Graph Neural Networks (GNNs) are a class of deep learning models that operate on graph-structured data. A graph is a mathematical structure that consists of a set of nodes (also called vertices) connected by edges. Graphs are used to represent many real-world systems, such as social networks, protein interactions, chemical molecules, and traffic flows. GNNs are designed to learn representations of graph-structured data, which can then be used for various downstream tasks, such as node classification, link prediction, and graph classification. GNNs have gained increasing popularity in recent years due to their ability to model complex dependencies between nodes in a graph and to capture high-level structural information. The core idea of GNNs is to propagate information between nodes in a graph [1].
At each layer of the GNN, the hidden state of a node is updated by aggregating information from its neighbors. The aggregation function can be any function that takes as input the hidden states of neighboring nodes and produces a new hidden state for the node. Common aggregation functions include summation, weighted summation, and max pooling. After aggregating information from its neighbors, each node updates its own hidden state by applying a non-linear transformation to the aggregated information and its own previous hidden state. The non-linear transformation can be any function that introduces non-linearity into the model, such as the sigmoid, tanh, or ReLU function. The process of information propagation and node updates is repeated for multiple layers until the model converges. The final hidden states of the nodes can then be used as representations of the graph [2].
There are several types of GNN architectures, each with its own way of aggregating information and updating node hidden states. Some of the most popular architectures include Graph Convolutional Networks (GCNs), Graph Attention Networks (GATs), and GraphSAGE. GCNs are a type of GNN that use convolutional filters to aggregate information from neighboring nodes. The convolutional filters are learned parameters that are applied to the node features and their neighboring features to produce a new hidden state for the node. GATs are a type of GNN that use attention mechanisms to weigh the importance of neighboring nodes when aggregating information. The attention mechanism assigns a weight to each neighboring node based on its relevance to the target node, which is learned during training. GraphSAGE is a type of GNN that uses a neural network to aggregate information from neighboring nodes. The neural network takes as input the hidden states of neighboring nodes and produces a new hidden state for the target node [3].
GNNs have been successfully applied to many real-world problems, such as node classification, link prediction, and graph classification. In node classification, the task is to predict the label of a node based on its features and the graph structure. In link prediction, the task is to predict whether there is an edge between two nodes in the graph. In graph classification, the task is to predict the label of a graph based on its structure. One of the key advantages of GNNs is their ability to capture the structural information of a graph. This allows GNNs to handle complex relationships between nodes, such as transitive relationships, which are difficult to model using traditional machine learning models. GNNs are also able to handle graphs of varying sizes and shapes, making them suitable for a wide range of applications. However, GNNs also have some limitations. One limitation is that they can be computationally expensive, especially for large graphs. Another limitation is that they may struggle to handle noisy or incomplete data, which can be common in real-world applications [4,5].
In conclusion, Graph Neural Networks are a powerful class of deep learning models that operate on graph-structured data. They have been successfully applied to many real-world problems and have the ability to capture the structural information.
